LLMs do not automatically retain application-specific context between independent sessions, forcing users to repeat preferences, project details, and previous decisions.

This session-reset issue severely impacts user experience and productivity. Users are frustrated when they have to re-enter the same information multiple times, and it slows them down. The lack of retaining context also makes collaborative work challenging, as team members struggle to pick up where others left off.

Implementing a persistent memory for AI agents can alleviate this problem. This solution provides a way for AI agents to hold onto context and recall it when needed, just like a human might remember a conversation or a project from weeks ago.

By integrating persistent memory for AI agents, developers can create more intuitive and efficient interactions between humans and AI. Users can work with AI models as if they were a trusted assistant, freely going back and forth between tasks and projects. This enhancement not only simplifies the user experience but also boosts productivity by minimizing the repetition of redundant tasks.

Why Persistent Memory Adds Value for AI Agents

When models store data in a traditional way, they can’t maintain context between interactions. They essentially reset with each new input, losing valuable knowledge gained previously. Persistent memory adds a layer around the model, allowing ideas to coexist and evolve over time.

This brings control over updates and retrieval. Instead of relying on a predetermined context window, the model can draw on a long-term memory when needed. Controlled updates allow AI agents to continuously learn and adapt without having to restart from scratch.

A model with persistent memory can recall previously acquired knowledge in context. This enables the AI to better understand the nuances of conversations, respond more coherently, and remember key details for extended periods.

Designing the Architecture for Persistent Memory

When designing architectures for persistent memory, separating data by purpose is crucial. This means using short-term memory to store recent conversation state and long-term memory to store durable user facts.

The conversation state is ephemeral and subject to change, whereas user facts are more permanent and less likely to change. By separating these types of data, the system can better manage and retrieve information, making it easier to maintain a coherent and accurate view of user interactions.

A relational database is an effective tool for storing long-term user facts, as it allows for structured and efficient data retrieval and updates. This is particularly useful for tasks such as updating user profiles or retrieving historical data.

However, when queries require a more flexible and scalable framework, a vector store can be used alongside the relational database. This combined approach enables a balance between structured data management and flexible querying capabilities.

A well-designed architecture like this enables efficient and controlled data retrieval and updates, making it easier to manage large amounts of persistent memory.

Building a Memory Service for Persistent Memories

To build a robust memory service, we need to create a set of API functions that can save, search, update, and delete memories. Each operation requires user IDs and metadata to scope the data, so we can ensure that only authorized users access and modify memories.

When creating the API functions, we’ll want to prioritize efficiency and scalability. This means considering how to optimize memory retrieval and matching, especially when working with large datasets.

We’ll embed metrics and metadata into the memory data itself, allowing us to store context and associated meaning. This will help ensure that our AI agents can access memories in a manner that accurately reflects the relationships between information.

Using semantic retrieval with embeddings, specifically from Pinecone, will be crucial in the implementation. This involves creating vectors that can capture the essence of the memories, even when data varies in formats and scales. As a result, our persistent memory for AI agents will greatly benefit from the enhanced accuracy and speed of retrieval.

The API functions will provide essential building blocks for integrating persistent memory capabilities within various applications, allowing AI agents to learn, recall, and apply information more effectively and efficiently.

Improving Recall and Retrieval with Semantic Search

Embeddings turn memories into searchable meaning, enabling related information retrieval. This is powered by advanced algorithms that analyze patterns and associations in vast amounts of data. The result is a system that can pinpoint relevant information, even when the search query is phrased differently.

Semantic search can find related information even when phrased differently. For instance, if you’re looking for results on a specific topic, the system can still identify relevant content even if the keywords are not explicitly mentioned. This flexibility is a significant improvement over traditional keyword-based search methods, where narrow phrases can exclude important information.

With semantic search, the memory service can process complex queries and associations with ease. This enables more efficient information retrieval, allowing users to access the information they need more quickly.

Implementing Persistent Memory Safeguards and Evaluation

Memory-specific access controls need to be implemented to ensure that AI agents only access and modify the persistent memories they need. This can include access control lists that dictate which memory locations are readable and writable.

Retention limits can also be put in place to prevent persistent memories from growing indefinitely. AI agents need to be able to learn and adapt, but they don’t need to retain all their memories forever. Setting retention limits can help prevent memory bloat and maintain network performance.

User-visible deletion is another crucial aspect of persistent memory safeguards. Users should be able to see what data is stored in the persistent memory and delete it when they no longer need it. This can be implemented with APIs that allow users to view and delete stored content.

Governance structures must be established to ensure memory security and integrity. This includes determining who has access to the persistent memory and how it is stored and managed.

Evaluating the impact of persistent memory on AI agent performance and user experience requires measuring memory usage, query response times, and user satisfaction. This can involve collecting metrics on these factors over time and comparing them to a baseline.

This evaluation also needs to consider the effects on different AI agents and user groups. Persistent memory can have different impacts on agents with varying task distributions and user groups with different needs and expectations.

New LLM versions may offer impressive gains in performance and lower costs, enticing teams to upgrade. However, these upgrades can silently break working features, often without warning.

Be wary of model upgrades that can change outputs enough to break existing workflows, prompts, and saved skills. LLM regression testing can help identify these issues before they become major problems. By running legacy and new models side by side, teams can assess the impact of the upgrade on their specific use cases.

Unfortunately, these changes can’t be predicted with certainty. Different models can process text in countless ways, and even the smallest tweak can have significant consequences. Test your workflow before upgrading to a new LLM version, and don’t be afraid to revisit and refine your evaluation dataset accordingly.

A smooth upgrade is often a matter of being prepared. By including LLM regression testing and ongoing workflow assessments in your development cycle, you can minimize the risk of disruption and ensure a seamless transition to the new model.

Treat Prompts like Production Code

Automated regression tests catch behavioral changes before a model upgrade reaches users.

Catch application regressions with tests before pushing changes live.

When updating an AI model, minor tweaks can sometimes have significant side effects. This is especially true for prompts or applications that rely heavily on the model’s output. Behavioral changes that seem insignificant in isolation can start to add up and cause problems down the line.

To catch these issues early on, it’s essential to have automated regression tests in place. These tests can simulate real-world interactions and identify any deviations from expected behavior. In this way, users can be alerted to potential problems before the model upgrade even goes live.

This isn’t just about preventing immediate disasters; it’s also an opportunity to refine and improve the overall experience. By catching regressions at the testing phase, developers can revisit the design and make intentional adjustments to mitigate any negative effects.

Don’t wait until it’s too late – set up automated regression tests to protect against the risks of unseen regressions. With this safety net in place, you can update your AI model with confidence, knowing that any potential issues will be caught and addressed before users are impacted.

Build a Representative Evaluation Dataset

To build a truly representative evaluation dataset, you need to capture realistic inputs and expected outcomes from your production workflows. This may involve collecting data on user interactions, system responses, and performance metrics.

Edge cases are just as important as regular scenarios. They often expose hidden issues, such as unusual requests, system failures, or security breaches. Your test dataset should include these cases to ensure your models are prepared for anything.

Save tasks that were previously successful so you can verify that new changes have not broken these areas. This ensures regression testing is thorough and catches all changes that might affect reliability.

Saving inputs and outcomes from production workflows, along with tasks that were previously successful, allows you to create a robust test dataset that is realistic and comprehensive. When you save these inputs and outcomes, you can make sure your model will perform as expected under various conditions, giving you confidence that it will behave correctly when put into production.

Compare Apples to Apples: Structured Output Comparison

When comparing structured outputs and tool calls, identifying regressions is crucial to ensure that changes don’t break downstream processes.

To do this reliably, it’s not enough to just compare exact text matches. Use policy compliance and task success metrics instead, which will give you a more comprehensive view of how well your system is performing.

Another challenge is snapshot behavior – the way your system behaves at different stages of its operations. To truly compare apples to apples, you need to snapshot behavior, not just exact wording.

This might involve creating a library of snapshots of how your system responds to various inputs and edge cases. This can then be used to compare against a new version of the system, to see if there’s any change in behavior that might indicate a regression.

LLM regression testing is essential to ensure that changes to language models don’t introduce new bugs or break existing functionality. By combining policy compliance and task success metrics with snapshot behavior, you can identify regressions with greater accuracy, and ensure that your language model continues to perform as expected.

This approach also helps you to identify subtle changes in behavior that might not be caught by a simple comparison of exact text matches. By looking at the broader picture, you can be more confident that your system is working as intended.

Run Legacy and New Models Side by Side

When upgrading to a new LLM version, the impact on your workflow and performance can be significant. One effective way to understand these changes is to evaluate the same test cases against both LLM versions.

This involves running your old and new models in parallel, side by side, to identify regressions and improvements. You’ll want to set up your evaluation environment to handle both models simultaneously, ensuring they’re receiving the same inputs and operating under the same conditions.

By comparing the performance of both models on the same test cases, you can pinpoint changes in latency and observe any significant variations in resource usage. This can be particularly helpful in determining whether the new model is worth the additional cost. Even if the new model improves performance in some areas, latency and cost differences may offset those gains.

Make Evaluations Part of CI/CD

In order to ensure high-quality results and prevent downstream issues, evaluations need to be woven into your continuous integration/continuous deployment (CI/CD) pipeline. This approach allows you to trigger targeted test suites when changes occur, guaranteeing that your models are performing optimally every step of the way.

However, many teams still release new models without thoroughly evaluating their performance. When releases are blocked solely based on missing critical thresholds in evaluations, it makes sense to catch issues early on through code-level testing instead.

Automating evaluations not only saves time but also helps teams catch problems at every stage of development. This ensures that any discrepancies or performance degradation are caught before they impact end-users.

When it comes to adopting AI across an engineering team, many businesses face a surprising challenge: not a lack of model capability, but rather a lack of a safe, consistent, and easy-to-use starting point for employees.

Individual experiments with AI tools can quickly descend into chaos if not managed properly. This can lead to inconsistent results, security risks, and decreased productivity as the team struggles to adopt the technology.

As AI solutions become more autonomous, teams need shared rules for permissions, tools, security, and workflows to avoid this chaos. This is where the Agent Harness Policy comes into play – a critical component of any successful AI adoption strategy.

The Agent Harness Policy sets the boundaries and guidelines for how AI tools will be used within the team. It’s a blueprint for ensuring that the benefits of AI adoption – increased productivity, improved accuracy, and better decision-making – are aligned with the team’s overall goals and standards. By establishing clear expectations and consequences, the Agent Harness Policy helps to ensure that AI adoption is a team effort, not a solo endeavor.

By starting with a solid Agent Harness Policy, teams can avoid the pitfalls of unmanaged AI adoption and reap the full rewards of this powerful technology.

Creating an Agent Harness Policy

Why harness engineering matters: A 2026 industry report from LangChain identifies quality-including reliability, accuracy, and output consistency-as the leading production obstacle for 32% of respondents, highlighting why the agent’s surrounding infrastructure matters as much as model selection.

Creating a version-controlled team configuration that specifies approved tools, filesystem access, network destinations, model choices, and actions requiring human approval, following the principle of least privilege is essential.

This team configuration outlines what a team can do and what they can’t, limiting their exposure and potential for mistakes. It also helps in maintaining a consistent environment across the board.

By defining the approved tools, the team ensures that everyone uses the same set of tools and doesn’t introduce inconsistencies in the development process.

Using lifecycle hooks to run formatters, secret scanners, policy checks, and audit logging before or after relevant agent actions, can help enforce these restrictions outside the model itself.

This enforces the safety measures to prevent or detect any errors that could arise from the actions being performed by the agents.

Configuring Subagents Purposefully

Configuring subagents purposefully is crucial for effective policy implementation. This involves defining specialized subagents for specific tasks, such as testing, code review, or documentation, with explicit responsibilities and corresponding permissions.

Subagents should be designed to perform a single task, rather than being multipurpose, to maintain their focus and avoid conflicting goals. This way, their actions are predictable and their impact on the system can be managed.

Make sure subagents have no broader permissions than their work requires. This means assigning the minimum necessary rights to accomplish their task, reducing the risk of unintended consequences.

When implementing subagents, integrate policies into the Continuous Integration/Continuous Deployment (CI/CD) pipeline. This allows for the validation of agent configuration files, security rules, architecture constraints, and evaluation tests, ensuring policy changes receive thorough review before they go live.

Policy changes are more likely to be checked and reviewed when they go through the CI/CD pipeline. If they are made in isolation, they can silently weaken the team’s safeguards, leading to vulnerabilities in the team’s policies.

Providing approved tool installations, reusable configuration templates, and concise onboarding instructions can make the first step in adopting AI tools easier and safer for employees. Give engineers a gentle learning curve by offering starter workflows and reusable building blocks that don’t require becoming experts in the agent framework first.

Assessing Reliability

Measure reliability and improve continuously: LangChain’s 2026 survey found that 89% of respondents had agent observability while only 52% reported offline evaluations, illustrating why teams should connect execution traces, policy violations, and real-world failures to repeatable regression tests.

Roll out autonomy incrementally: Start with read-only assistance and local code changes, progress to controlled file edits and CI execution, and permit deployments or other consequential actions only when permissions, evaluations, auditability, and human approvals meet defined standards.

Agent observability helps identify and resolve issues before they affect the production environment. This allows your team to pinpoint the root cause of issues, make targeted improvements, and ensure the stability and reliability of your system.

To develop a robust Agent Harness Policy, consider integrating agent observability, offline evaluations, and repeatable regression tests. This policy should be flexible enough to accommodate different use cases and requirements, yet robust enough to ensure that your system remains reliable and efficient.

Implementing an Agent Harness Policy requires a gradual approach, starting with read-only assistance and progressing to controlled file edits and CI execution. Each step should be carefully evaluated and audited before moving on to the next phase.

Adopting and Measuring Agent Harness Policy

Here’s how to implement an effective agent management strategy that’s in sync with your business goals and priorities. To start, consider your overall business objectives and how your Agent Harness Policy can support them. Be specific about what you want to achieve and what metrics will indicate success.

To implement a successful agent management strategy, you must regularly review and update the Agent Harness Policy. This should be a constant process, with ongoing monitoring and adjustments to stay current with changing needs and industry developments. Make sure to align your policy with your evolving business goals.

To measure the effectiveness of your Agent Harness Policy, establish clear metrics and use data to inform your decision-making. Focus on specific, actionable data that helps you understand what’s working and what areas need improvement. Regularly reviewing and updating your policy, along with using data-driven metrics, will help you achieve your business objectives.

Set specific, quantifiable goals for your Agent Harness Policy. This will give you a clear direction for your strategy and make it easier to measure its success. Also, make sure to track the progress towards achieving these goals and be prepared to make adjustments if necessary. Your metrics should be comprehensive and include areas such as efficiency, productivity, and quality.

Putting it all into Practice

Implementing the Agent Harness Policy effectively requires a collaborative effort among team members, fostering a culture of open communication and active engagement. This ensures that everyone is working together towards a common goal – optimizing the policy to achieve reliable and efficient operations.

When adopting the Agent Harness Policy, teams can expect to see improvements in several key areas. Workflow processes become streamlined, reducing unnecessary steps and minimizing delays. Decision-making becomes more informed, as stakeholders have access to relevant data and insights. By pooling expertise and insights, teams can troubleshoot and resolve problems more efficiently.

As the policy is implemented, it’s essential to continuously monitor its effectiveness. Establishing a feedback loop allows teams to identify areas for improvement and make adjustments as needed. Regular check-ins and progress updates ensure that everyone is on the same page and working towards the same objectives.

By adopting and adhering to the Agent Harness Policy, teams demonstrate their commitment to delivering top-notch results and staying ahead of the competition. Reliable operations and efficient workflows become the standard, allowing teams to stay agile and adapt to changing circumstances with ease. The end result is a more streamlined and effective operation, one that is better equipped to tackle the challenges of the industry.

Large language models have changed what software can do. Customer support assistants can answer questions around the clock, coding tools can generate entire functions, recommendation systems can personalize experiences, and writing assistants can produce useful content in seconds. A few years ago, many of these capabilities seemed unrealistic; today, they are becoming standard features in modern applications.

But there is an important catch: an LLM can produce an answer that sounds completely convincing while being wrong and the new big topic is how to prevent AI hallucinations in production.

This is what we commonly call a hallucination. The model may invent a fact, cite a nonexistent source, misunderstand retrieved information, call a tool incorrectly, or confidently answer a question when it simply does not have enough information. In a production application, that is more than an interesting limitation of AI. It is a reliability problem.

The good news is that hallucinations do not have to be accepted as an unavoidable part of building with LLMs. The most reliable systems use multiple layers of protection around the model rather than expecting the model itself to always behave correctly.

The key mindset shift is simple: don’t try to eliminate hallucinations with one perfect prompt; engineer the system so that incorrect answers are harder to produce, easier to detect, and less damaging when they occur.

That means grounding responses in trusted data, validating model outputs, allowing the model to abstain, evaluating the complete AI pipeline, and continuously learning from failures observed in production.

Not Every Failure Is a Hallucination

Before fixing hallucinations, it helps to understand what actually went wrong. Treating every incorrect response as the same problem often leads to ineffective solutions.

Consider a customer-support assistant that tells a user an incorrect refund policy. Several different things could have happened. The relevant policy might never have been retrieved. The correct document might have been retrieved, but the model could have misunderstood it. The information could have been outdated. The model might have invented a detail that was not present in the source. Or an external tool could have returned incorrect data.

These are different failure modes and require different solutions.

Retrieval failures happen when the system cannot find the right information. Improving document chunking, metadata, embeddings, search queries, or reranking may help here.

Unsupported claims occur when the model generates information that cannot be supported by the available evidence. Better grounding and verification are appropriate defenses.

Factual errors may require checking the answer against an authoritative database or deterministic business logic rather than another language model.

Instruction failures happen when the model does not follow the application’s requirements, such as returning invalid fields or ignoring constraints.

Finally, tool and agent failures can happen when an AI system calls the wrong tool, uses incorrect parameters, misinterprets its result, or takes an inappropriate action.

This classification matters because a better prompt will not fix a broken retrieval pipeline, and adding more documents will not necessarily fix faulty business logic.

Production AI should therefore be debugged like any other distributed system: identify the failing component first, then apply the appropriate engineering control.

Ground Answers in Trusted Evidence

One of the most effective ways to reduce hallucinations is to give the model access to information it should actually use.

Retrieval-augmented generation, or RAG, is a common approach. Instead of asking the model to rely entirely on information encoded during training, the application retrieves relevant documents and includes them as context when generating the response.

For example, imagine an internal IT assistant answering, “How do I reset my company laptop?” Rather than expecting the model to know the company’s current procedure, the system can retrieve the relevant internal documentation and ask the model to answer based on that material.

This approach is powerful, but RAG is not a magic anti-hallucination switch.

If retrieval returns irrelevant documents, the model is still working with bad information. If the knowledge base is outdated, the generated answer may faithfully reproduce outdated information. If the relevant information is missing entirely, the model may fill the gap using its own assumptions.

For production systems, the quality of retrieval therefore deserves as much attention as the quality of generation. Measure whether the correct documents are being retrieved, use metadata and filters where appropriate, and prefer authoritative sources for sensitive information.

Sometimes RAG is not even the best solution. For current prices, account balances, order status, permissions, or other structured facts, calling an authoritative API or database is usually safer than asking a model to generate the answer from documents.

A useful rule is: use the model for language and reasoning, but let authoritative systems remain the source of truth for facts that matter.

Let the Model Say “I Don’t Know” and Prevent AI Hallucinations in Production

A surprisingly important production capability is allowing the model to refuse to answer.

Many AI applications implicitly encourage hallucinations by requiring an answer to every question. If the system provides no reliable evidence but still expects a confident response, the model has an incentive to produce something plausible.

Instead, design the application around abstention.

Suppose a legal-document assistant receives a question about a policy that does not exist in its knowledge base. A safer response is:

“I don’t have enough information in the available documents to answer that.”

That may look less impressive than a detailed answer, but from a reliability perspective it can be far more valuable.

Abstention can also be enforced systematically. The application can require a minimum retrieval score, require citations for factual claims, or send uncertain responses through an additional verification step. If the necessary evidence is missing, the backend can prevent the response from being presented as authoritative.

This is especially important in high-risk applications where a wrong answer is significantly worse than no answer.

The goal is not necessarily to maximize the percentage of questions answered. The better goal is to maximize correctly answered questions while minimizing confidently incorrect ones.

This introduces an important production trade-off. A system that answers everything may have impressive coverage but poor reliability. A system that refuses everything is safe but useless. Good AI engineering finds the appropriate operating point for the application’s risk tolerance.

Abstention should therefore be treated as a legitimate outcome and measured alongside accuracy. Track how frequently the system refuses, why it refuses, and whether those refusals were actually appropriate.

Verify Before You Trust

For low-risk applications, generating a response directly from grounded context may be sufficient. For high-value operations, however, trusting a single generation step is often not enough.

A stronger architecture separates generation from verification.

Imagine an AI assistant that summarizes an insurance claim. Instead of simply checking whether the overall summary “sounds correct,” the system can extract individual claims such as the incident date, claim amount, policy number, and reported damage. Each claim can then be checked against the original records.

The same principle works for many applications. A coding assistant can have generated code checked by a compiler and automated tests. A financial application can validate calculations against deterministic code. A customer-support system can verify policy statements against its source documents.

This is powerful because traditional software is exceptionally good at checking things that language models are not. A backend service can determine whether a number is within an allowed range, whether an enum value is valid, whether a user has permission to perform an action, or whether a calculation matches the expected result.

Structured outputs make this approach easier. Instead of asking a model to return an arbitrary block of text, require a defined schema with fields, types, and allowed values. The backend can then validate the response before it reaches the user or triggers an action.

For particularly important claims, a separate verification model can also evaluate whether the generated statement is supported by the supplied evidence. But model-based verification should complement deterministic checks, not replace them.

The broader principle is straightforward: never give a probabilistic system responsibility for a constraint that ordinary software can enforce reliably.

Evaluate, Trace, and Improve Continuously

A production AI system is never finished. Models change, prompts evolve, retrieval indexes are rebuilt, documents become outdated, and user behavior introduces unexpected edge cases.

That makes continuous evaluation essential.

Start with a representative evaluation dataset containing real user questions, difficult examples, known hallucinations, and adversarial cases. Run this dataset whenever you change the model, prompt, retrieval system, or surrounding application.

Do not rely on a single “accuracy” number. Track metrics that correspond to the actual failure modes of your system: answer correctness, groundedness, retrieval quality, abstention rate, tool-call correctness, and regression rate.

Observability is equally important. When an incorrect answer appears in production, engineers need to reconstruct what happened. A useful trace should capture the model and prompt version, user input, retrieved documents, tool calls, relevant intermediate steps, final output, and available user feedback.

Without this information, debugging becomes guesswork. With it, an engineer can determine whether the problem came from retrieval, generation, a tool, stale data, or an application-level validation failure.

Most importantly, production failures should become future tests. When a customer discovers a hallucination, add that example to the evaluation set. The next model or prompt version should prove that the same failure has not returned.

Over time, this creates a feedback loop: observe failures, understand their causes, turn them into tests, improve the system, and continuously measure the result.

That is how hallucination prevention becomes an engineering discipline rather than a collection of prompt tricks.

Conclusion: Engineer for Reliable AI

Hallucinations are one of the most visible weaknesses of modern LLM applications, but they are not simply a problem that developers have to accept.

The most reliable approach is to treat an AI feature as a complete software system. First, identify what kind of failure occurred. Then ground the model in authoritative information, retrieve carefully, and use APIs or databases whenever they are a better source of truth.

Give the model permission to say that it does not know. Validate structured outputs before using them. Verify important claims against evidence and use deterministic business rules wherever possible. Most importantly, continuously evaluate the system using realistic production examples rather than assuming that a model that worked during development will remain reliable forever.

There is also an important lesson in all of this: the model should not be the only component responsible for correctness.

Modern AI systems work best when probabilistic models are surrounded by deterministic engineering. The model handles language, interpretation, and flexible reasoning, while retrieval systems provide evidence, APIs provide authoritative facts, validators enforce constraints, and evaluation systems measure whether everything works as expected.

You probably cannot guarantee that an LLM will never hallucinate. You can, however, build a production system where hallucinations are less frequent, easier to detect, prevented from triggering dangerous actions, and continuously turned into opportunities for improvement.

That is the practical path from an impressive AI demo to a reliable AI product.

AI agents are only as effective as the context they can access. This means that the quality of the data they receive, and the relevance of that data, directly impact the accuracy and usefulness of their output.

Context engineering is increasingly as important as prompt engineering. By carefully crafting the context in which AI systems operate, developers can ensure that the models receive the most relevant information and are better equipped to deliver high-quality results.

The challenge for engineering teams is no longer simply giving AI a file. Rather, they need to consider the intricacies of AI context engineering, crafting a rich and nuanced context that allows the AI to understand the problem at hand. This involves more than just providing a dataset or a prompt – it requires a deep understanding of the task, the data, and the desired outcome.

A well-engineered context can make all the difference in the success of an AI system. By providing the right context, developers can improve the accuracy and reliability of the AI’s output, and ultimately, deliver better results to users. Effective AI context engineering requires a thoughtful and intentional approach, one that takes into account the complexities of the task and the needs of the user.

Role-Specific Context for AI Context Engineering

Developers need repositories to store their code, architecture to guide the project’s structure, APIs to communicate between systems, tests to ensure functionality, and conventions to maintain consistency throughout the project.

Testers may require business rules to understand the project’s logic, acceptance criteria to verify the product meets requirements, and product documentation to grasp the overall vision.

Each role requires a tailored set of context for AI to perform tasks effectively. Developers’ context involves understanding the project’s technical aspects, including the tools and technologies used. Testers’ context revolves around the product’s non-technical aspects, such as its functionality and business rules.

For AI to contribute meaningfully, it needs to be aware of these differences and adapt its context accordingly. By providing role-specific context, we can enable AI systems to provide more accurate and relevant information, and ultimately, improve the development and testing process.

Creating a Shared Context Foundation for AI Context Engineering

Maintaining authoritative sources for architecture, coding standards, and business rules is essential to prevent copying conflicting information into individual prompts.

A shared context foundation is crucial for consistency and accuracy, enabling teams to work together seamlessly and reducing errors.

This foundation also helps to ensure that AI models are trained on accurate and reliable data, which is critical for making informed decisions.

Establishing a shared context foundation requires a clear understanding of the organization’s architecture, coding standards, and business rules, as well as a willingness to document and maintain these sources.

Using standardized tools and frameworks can help to streamline this process and ensure that all team members have access to the same information.

Consistency in data and information is key to successful AI context engineering, and a shared context foundation provides a solid foundation for achieving this consistency.

By maintaining a shared context foundation, teams can avoid confusion and errors, and ensure that their AI models are accurate and reliable.

Context Engineering Strategies for AI Context Engineering

Retrieve the smallest high-signal context needed for the current task. This approach avoids the pitfalls of large context windows that can lead to distraction, redundancy, or degraded performance.

Instead, agents can focus on fetching relevant information on demand through tools and retrieval systems. This targeted approach ensures that the right context is available at the right time, without overwhelming the system.

Effective AI context engineering relies on this ability to retrieve and process the smallest necessary context. By doing so, agents can conserve resources, improve accuracy, and make more informed decisions. This targeted approach also enables agents to adapt to changing situations and learn from new information.

In the context of AI context engineering, this means that agents should be designed to retrieve context in a way that is efficient, flexible, and scalable. By taking a small but high-signal context approach, agents can achieve better performance and more accurate results in a variety of tasks and applications.

Managing Complex Context for AI Context Engineering

Stable instructions are crucial for managing complex context. They provide a foundation for decision-making, helping to distinguish between relevant and irrelevant information. Task-specific information is then layered on top, refining the context and enabling more informed choices.

Retrieved knowledge plays a vital role in shaping context, but it must be carefully managed to avoid overwhelming the system. This is where summarization, trimming, and compression come into play. By prioritizing essential information and discarding unnecessary data, AI systems can maintain a clear and focused context.

Long-running context can be particularly challenging, as it accumulates a vast amount of information over time. To mitigate this, context engineering strategies focus on managing context memory. This involves structuring and organizing knowledge in a way that preserves important decisions and facilitates efficient retrieval.

Emerging Skill: Context Engineering for AI Context Engineering

Engineers will increasingly need to master the skill of context engineering to design information flows effectively. This involves deciding what information agents see, when they see it, and where it comes from.

Context engineering is crucial for the development and deployment of artificial intelligence. As AI systems rely heavily on data, understanding how information is presented and consumed is vital. By designing the context in which AI agents operate, developers can create more intuitive and efficient systems.

In practice, context engineering means considering the source and relevance of information. This requires thinking about the relationships between different data points and how they interact with each other. It also involves determining how to present information in a way that is clear and actionable.

Developers who possess context engineering skills will be able to create AI systems that are more responsive to user needs. They will be able to design information flows that are tailored to specific use cases and contexts. This emerging skill will play a critical role in shaping the future of AI development.

As AI continues to evolve, the need for skilled context engineers will only grow. These individuals will be responsible for ensuring that AI systems are designed with the right information, at the right time, and in the right context. By doing so, they will help to create more effective and reliable AI systems.

Traditional security principles may seem like a relic of the past, but they still hold relevance in the realm of AI agent security. However, their application requires adaptation to the unique challenges posed by these systems. The age-old mantra of “secure by design” takes on a new meaning when applied to AI, where the lines between code and behavior are increasingly blurred.

Probabilistic model behavior is now a fundamental aspect of an AI system’s attack surface. This is an area that was once considered the exclusive domain of machine learning engineers, but it’s now a pressing concern for security professionals. By embracing this reality, we can begin to develop more effective countermeasures to address the unique risks associated with AI agent security.

The security landscape of AI is evolving rapidly, with new threats and vulnerabilities emerging at an alarming rate. As AI becomes increasingly integrated into our daily lives, the need for robust security measures becomes more pressing. This means that security professionals must be prepared to adapt and evolve their strategies to keep pace with the changing landscape of AI agent security.

Understanding Prompt Injection Risks

When you interact with an AI agent, it’s not just the information it provides that you should be concerned about. External content can be untrusted input, and that’s a crucial distinction to make.

This external content can take many forms, including web pages and emails. Think about it – have you ever clicked on a link in an email or visited a website without thinking twice about where it was coming from? That’s exactly how prompt injection can happen.

Prompt injection is a type of attack where an agent is tricked into performing a task that it wasn’t designed to do. This can be achieved through indirect prompt injection, where an attacker manipulates the input to the agent in a way that hijacks its functionality.

The problem is, web pages and emails can be malicious. They may look harmless at first glance, but they can contain code that’s designed to manipulate the agent. This code can be crafted to trick the agent into performing a specific task, or to reveal sensitive information.

So, what can you do to protect yourself? Treat web pages and emails with caution. Be wary of links and attachments, and don’t click on anything that looks suspicious.

Applying Least Privilege Principle

When designing AI agents, it’s essential to grant them only the minimum permissions and capabilities necessary to perform their tasks. This concept is known as least privilege principle, and it’s a crucial aspect of maintaining security.

Limiting autonomy to task requirements ensures that agents don’t have the freedom to make decisions that could compromise security. For instance, an agent tasked with data analysis should only be able to access the data it needs to perform its analysis, and nothing more.

Restricting credentials and network access is also vital, as it prevents unauthorized access to sensitive information. This can be achieved by using role-based access control, where agents are assigned specific roles that dictate their level of access.

By implementing these measures, you can significantly reduce the risk of security breaches and minimize the potential damage they could cause. It’s worth noting that even a small mistake can have far-reaching consequences, so it’s crucial to be meticulous when granting permissions and access.

Securing Tools and MCPs

When it comes to security, treating tool servers and plugins as part of the security boundary is crucial. This means considering them as an integral part of the overall system, just like any other component. Think of it as a digital fortress, where every entrance and exit is carefully guarded.

APIs and tool outputs should be carefully vetted to ensure they don’t introduce any vulnerabilities. This is especially true when it comes to sensitive information or high-risk operations. Think of it as a quality control check, where every output is scrutinized to ensure it meets the desired standards.

Untrusted extensions should be blocked or restricted, as they can pose a significant risk to the security of your system. This includes any third-party plugins or add-ons that may have been compromised or are of unknown origin. By limiting access to such extensions, you can significantly reduce the attack surface and prevent potential breaches.

For instance, in the context of AI agent security, untrusted extensions can cause significant harm if they’re able to manipulate or exploit the system. This is why it’s essential to exercise caution when dealing with external components, and to always prioritize the security of your system above all else.

Implementing Effective Sandboxing

Isolating agent execution with filesystem boundaries is crucial in preventing malicious activity. This means limiting the agent’s access to sensitive data and resources, reducing the attack surface and potential damage in case of a breach.

Network and credential isolation is also essential in protecting the agent from potential threats. By restricting the agent’s communication with external systems and limiting its access to credentials, you can prevent unauthorized access and exploitation.

Sandboxing prevents agent escape and exploitation by creating a secure environment for the agent to execute. This environment is isolated from the rest of the system, preventing the agent from accessing sensitive data or causing harm.

Protecting Data and Enforcing Approval

To prevent sensitive data from entering model context, it’s essential to ensure that it doesn’t reach the model at all. This can be achieved by implementing robust input validation and sanitization mechanisms. This involves carefully examining the data before it’s processed, ensuring that it conforms to expected formats and doesn’t contain any malicious content.

When a high-impact action is required, it should be handled with caution. This is why requiring human confirmation is a must. By doing so, we can prevent unintended consequences and ensure that only authorized actions are taken. This also helps in reducing the risk of errors and missteps.

Approval interfaces can be manipulated through injected content. This is a significant concern, as it can lead to security breaches and other issues. To mitigate this risk, it’s crucial to use secure and reliable approval interfaces that can’t be easily manipulated. This involves implementing robust security measures and closely monitoring the interfaces for any signs of tampering.

Conclusion: Embracing Evolving AI Agent Security

Traditional security skills need to be upskilled to keep pace with the rapid evolution of AI agent security. This means that security professionals must stay ahead of the curve by learning new skills and adapting to emerging threats.

Threat modeling and testing are essential components of AI agent security. By identifying potential vulnerabilities and testing for weaknesses, organizations can ensure that their AI systems are secure and reliable. Effective threat modeling and testing require a combination of technical expertise and creative thinking.

The security of AI agents will continue to evolve rapidly as new technologies emerge. As AI becomes more integrated into our daily lives, the need for robust security measures will only grow. This means that organizations must be proactive in staying ahead of potential threats and continually updating their security protocols.

Security professionals must be prepared to adapt to new technologies and emerging threats. This requires a combination of technical expertise, creative thinking, and a willingness to learn and evolve. By upskilling and staying ahead of the curve, security professionals can help organizations protect their AI systems and maintain trust in these increasingly critical technologies.

Codebase Exploration: Navigating the Unfamiliar with AI Agent Use Cases

Investigating unfamiliar repositories can be a daunting task, especially when dealing with a large codebase. But with the help of AI agents, developers can now explore these repositories with ease. AI agents can analyze the code and provide insights into the architecture, making it simpler for developers to understand the project’s structure and dependencies.

AI agents can also assist in tracing dependencies, which is crucial for identifying potential issues or areas for improvement. By analyzing the code and its relationships, AI agents can provide a clear picture of the codebase, allowing developers to focus on implementing changes with confidence. Moreover, AI agents can help identify relevant files for implementation, streamlining the development process and reducing the likelihood of errors.

By leveraging AI agents for codebase exploration, developers can save time and effort, and focus on writing high-quality code. This approach also enables teams to collaborate more effectively, as AI agents can provide a common understanding of the codebase, reducing misunderstandings and miscommunications. With AI agents by their side, developers can now tackle unfamiliar codebases with ease and confidence.

AI Agent Use Cases in Bug Fixing: A Proven Workflow

Give agents a reproducible issue and let them inspect logs.

When a bug arises, AI agents can be handed a specific, replicable problem to solve. This allows them to inspect relevant logs, pinpoint the root cause of the issue, and work toward a resolution.

This reproducible environment empowers agents to learn from their mistakes and refine their approach. By having a controlled setting, agents can fine-tune their skills and apply them to a broader range of scenarios.

Agents are then able to modify code, run tests, and iterate toward a verified fix. Through this process, they can identify areas of improvement in their own performance and develop more effective strategies.

Coding agents have demonstrated credibility in benchmarks, consistently producing accurate results and solving complex problems. This level of proficiency can be attributed to their ability to learn from their experiences and adapt to new challenges.

Generating Missing Tests with Ease

Agents are particularly useful for generating missing tests. They can replicate failure scenarios and identify the root cause of issues, making it easier to expand edge cases.

With AI agent use cases, you can simulate various user interactions and environments to ensure your application behaves as expected. This level of testing is crucial for catching subtle bugs and regressions that might have been introduced during development.

One of the key benefits of using AI agents is their ability to run the test suite to validate changes with confidence. By automating this process, you can quickly identify which tests are failing and pinpoint the specific lines of code causing the issue. This efficiency boost allows developers to focus on writing new code and improving the overall quality of the application.

By leveraging AI agent use cases, you can create a comprehensive testing strategy that catches issues early on, reducing the likelihood of downstream problems and costly rework.

Refactoring and Code Review

When it comes to refactoring and code review, AI agents can be invaluable tools. One key area where they shine is in delegating well-scoped migrations and API updates. By automating mundane tasks, AI agents free up developers to focus on more complex and high-value work.

The process begins with a thorough review of the codebase. AI agents can perform a first-pass review for bugs and security issues, helping identify potential problems before they cause issues downstream. This is not a replacement for human code review, however – humans retain final responsibility for ensuring the quality and security of the code.

In fact, AI agents work best when used in conjunction with human expertise. By serving as a second pair of eyes, AI agents can help developers catch errors and inconsistencies that might have otherwise gone unnoticed. This collaboration between humans and AI agents is key to producing high-quality code that meets the highest standards of security and reliability.

DevOps/Maintenance: AI Agent Use Cases for Smarter Operations

Investigate CI failures and analyze logs with AI agents, quickly pinpointing the root cause of issues and identifying areas for improvement. By automating this process, teams can reduce the time spent on debugging and focus on delivering value-added work.

Update configuration and prepare fixes with AI guidance, ensuring that changes align with best practices and don’t introduce new problems. AI agents can analyze the codebase, identify potential issues, and suggest the necessary updates, all while minimizing the risk of human error.

When it comes to production-changing actions, explicit approval is required, ensuring that all stakeholders are on the same page. This is a crucial step in maintaining transparency and accountability within the team.

Conclusion: Unlocking the Potential of AI Agent Use Cases

AI agents are designed to augment human capabilities, not replace them. By properly utilizing these tools, developers can significantly boost productivity and streamline their workflow.

Clear goals and repository conventions are essential when integrating AI agents into software development. This ensures that all team members understand the role and limitations of these agents, allowing for seamless collaboration and effective problem-solving.

Establishing tool permissions and access control is also crucial. This prevents unauthorized access to sensitive data and ensures that AI agents operate within predetermined boundaries.

Treating AI agents as supervised junior engineers is a useful analogy. Just as junior engineers learn and grow under the guidance of experienced team members, AI agents can be trained and monitored to improve their performance and accuracy.

Stopping conditions for AI agents must be clearly defined to prevent over-reliance on these tools. This involves setting limits on the tasks they can perform, the data they can access, and the decisions they can make. By doing so, developers can strike a balance between leveraging AI agent capabilities and maintaining human oversight and control.

When building complex AI systems, speed often takes priority over long-term viability. This can lead to a situation where the system becomes increasingly difficult to modify or replace. The result is a fragile architecture that’s prone to obsolescence.

As developers focus on rapidly deploying models, the underlying infrastructure may not be designed to adapt to changing needs. This can make it challenging to integrate new features or technologies without rewriting significant portions of the codebase. The consequences of such a rigid architecture can be severe, making it difficult to keep up with shifting business requirements or technological advancements.

The accumulation of Architectural AI debt is a real concern in this context. It refers to the gradual buildup of technical debt that arises from prioritizing short-term gains over long-term maintainability. As the system grows more complex, the debt becomes harder to pay back, ultimately hindering its ability to evolve and improve over time.

Developers need to adopt a more thoughtful approach to AI development, prioritizing architecture and design that will stand the test of time. This requires a shift in focus from rapid prototyping to more deliberate and intentional design choices. By doing so, they can create systems that are more flexible, maintainable, and better equipped to handle the demands of an ever-changing environment.

The Danger of Model Lock-in

Model training often relies on specific tools and infrastructure, making it challenging to switch to new providers or models. This model lock-in can have significant consequences for businesses and organizations that rely on these models.

One of the primary issues with model lock-in is the difficulty in replacing or updating models when they become outdated or obsolete. This can be due to various factors, such as changes in business needs, advancements in technology, or the availability of new models. However, when models are tied to specific tools and infrastructure, it can be costly and time-consuming to switch to new providers or models.

Another concern is the vendor lock-in that often occurs when businesses rely on proprietary tools and infrastructure. This can limit their flexibility and ability to switch to alternative solutions, even if they offer better performance or functionality. By prioritizing flexibility and replaceability in model architecture, businesses can avoid these pitfalls and maintain a competitive edge.

In architecture, flexibility and replaceability should be top priorities. This means designing models that can be easily adapted to different tools and infrastructure, without sacrificing performance or functionality. By doing so, businesses can ensure that their models remain relevant and effective over time, even as technology and business needs continue to evolve.

Designing for Evaluation and Context

Automated evaluations and quality metrics are crucial components in any system. They provide a clear understanding of how well the system is performing and help identify areas for improvement.

Context pipelines can introduce complexity and hidden coupling. This can make it difficult to modify or extend the system without introducing unintended consequences.

Designing for evaluation and context is key to reducing debt. This involves considering how the system will be used and evaluated from the start, rather than trying to add these features later.

When designing a system, it’s essential to think about how it will be evaluated and what metrics will be used to measure its success. This can help prevent the introduction of unnecessary complexity and reduce the risk of hidden coupling.

Automated evaluations can help identify problems early on, and quality metrics can provide a clear understanding of the system’s performance. By designing for evaluation and context, developers can create systems that are easier to maintain and modify.

Designing for evaluation and context also involves considering the context in which the system will be used. This can include factors such as user behavior, data quality, and system limitations.

By taking these factors into account, developers can create systems that are more robust and easier to work with. This can help reduce the risk of architectural debt and make it easier to maintain and extend the system over time.

The Challenges of Agentic Systems

Agentic systems introduce additional complexity and debt. This complexity can quickly escalate into a major problem if not managed properly. Orchestration, memory, and tool dependencies can be major sources of issues, as each new component or integration adds another layer of potential failure points.

Managing the complexity of agentic systems requires simple, observable boundaries. These boundaries help organize and limit the scope of the system, making it easier to identify and address problems as they arise. However, without clear boundaries, the system can become a tangled web of interconnected components, making it difficult to pinpoint the source of issues.

The presence of tool dependencies can further exacerbate the problem. Different tools and software may have varying levels of compatibility, requiring additional workarounds and patches to maintain a smoothly functioning system. This not only adds to the overall complexity but also introduces the risk of Architectural AI debt, as the system becomes increasingly reliant on specific tools or software.

In order to mitigate these risks, it’s essential to prioritize the development of clear, observable boundaries. By doing so, you can reduce the complexity of the system and make it easier to identify and address issues as they arise. This approach may require additional upfront work, but it can help prevent the accumulation of Architectural AI debt and reduce the risk of system-wide failures.

Human Oversight in AI Architecture

While AI coding tools can significantly accelerate the implementation process, they cannot replace human judgment. These tools can provide valuable assistance in automating repetitive tasks, but ultimately, it is the human architect who must own the architecture, constraints, and trade-offs.

Generated code can accumulate unresolved quality and security issues, which may not be immediately apparent. AI tools can help identify potential problems, but they often lack the nuance and contextual understanding that a human eye brings to the table.

This is particularly relevant in the realm of AI architecture, where the consequences of a misstep can be severe. An architecture that is overly reliant on automated tools may fail to account for the unique constraints and requirements of a particular project.

Furthermore, AI tools can perpetuate existing biases and assumptions, rather than challenging them. Human architects, on the other hand, can bring a critical perspective to the design process, ensuring that the resulting architecture is fair, robust, and adaptable.

Ultimately, the role of human oversight is to ensure that AI tools are used as a means to an end, rather than an end in themselves.

Managing Architectural AI Debt

Paying down architectural AI debt is critical to maintaining a healthy system. This involves continuously reviewing and updating the architecture to ensure it remains aligned with evolving needs and goals. By regularly assessing and refining the system’s design, you can prevent debt from accumulating and ensure that your AI remains agile and effective.

To manage architectural AI debt effectively, you need to prioritize ongoing efforts such as architecture reviews, dependency upgrades, and evaluation maintenance. This includes keeping track of dependencies, updating them as necessary, and continuously evaluating the system’s performance to identify areas for improvement. By staying on top of these tasks, you can prevent debt from building up and ensure that your system remains stable and secure.

Refactoring and security testing are also essential components of managing architectural AI debt. By regularly refactoring code to improve its maintainability and security, you can reduce the risk of errors and vulnerabilities. Additionally, ongoing security testing can help identify potential threats and vulnerabilities, allowing you to take proactive steps to address them.

By making these efforts a priority, you can prevent architectural AI debt from becoming a major issue and maintain a healthy, effective AI system. This requires ongoing attention and investment, but the benefits are well worth the effort.

With the advancements in technology, users are gaining substantial control over the availability and data handling of their AI applications by running local AI models. This shift is empowering individuals to decide how and when their data is processed, offering a high level of autonomy.

Smaller open-weight models are becoming surprisingly capable, defying initial expectations. They’re not just limited to simple tasks; they’re capable of handling complex computations with ease. This development is paving the way for a new generation of AI models that can be deployed locally, without relying on cloud infrastructure.

One of the significant advantages of local inference is that it removes dependence on the provider’s API availability. This means that users can continue to use their AI models even if the cloud service is down or experiencing issues. This level of reliability is crucial for applications that require constant access to AI-driven functionality.

Why the Gap Between Cloud and Local AI Models is Narrowing

Advances in AI model development have led to a significant decrease in the size of AI models, making them more portable and suitable for various devices.

Google, Microsoft, and other tech giants are now focusing on laptops, workstations, and edge devices, which were previously thought to be underpowered for complex AI computations. This shift highlights the growing importance of local, on-device AI processing.

Smaller AI models can run comfortably on laptops, reducing the reliance on cloud infrastructure. These models rely on specialized hardware and software to achieve efficient inference, further bridging the gap between cloud and local AI models.

The rapid improvement in hardware and inference software has made it possible for AI models to perform competitively on local devices. This trend shows no signs of slowing down, as the industry continues to develop more efficient and compact AI models.

The Benefits of Control with Local AI Models

With the dependence on a provider’s API removed, you’re free to focus on building and refining your model without the constraints of a third-party service. Your sensitive source code and prompts remain safely contained within your environment, giving you complete control over how they’re used and accessed.

Developers gain full control over their model and infrastructure, allowing for greater precision and customization. By hosting your AI model locally, you’re able to tailor it to your specific needs and make adjustments as required. This level of control also enables you to integrate your model with other systems and tools, creating a seamless and efficient workflow.

Having your model and infrastructure under your control also means you’re not at the mercy of a provider’s uptime or maintenance schedule. Your model will continue to run and process data even when the internet connection is down, ensuring that critical tasks can still be completed. This level of reliability is invaluable for businesses and organizations that require high uptime and minimal disruption.

Cost Considerations for Local AI Models

When it comes to hosting local AI models, one significant advantage is the elimination of recurring API or token costs.

These costs can add up quickly, especially when processing large amounts of data. By hosting models locally, you can avoid these ongoing expenses and allocate your budget to other areas.

However, it’s essential to consider the upfront costs associated with local AI models. This includes the cost of electricity, hardware depreciation, and maintenance. The specific costs will vary depending on the size of the model and the number of users.

For instance, a large-scale model will require more powerful hardware and potentially more energy to run. On the other hand, a smaller model may be more cost-effective in terms of hardware and energy consumption.

The hardware requirements for local AI models can also vary significantly. Different models will have unique specifications, and the size of the model will play a significant role in determining the necessary hardware.

In general, larger models will require more powerful processors, more memory, and potentially more storage. This can result in higher upfront costs, but it can also provide a more efficient and cost-effective solution in the long run.

Tiers of Capability with Local and Cloud AI Models

Local models excel in tasks that require intricate coding, summarization, and classification. They are able to efficiently process and analyze specific data, offering precise results that meet the requirements of a particular application. This is because local models are trained on smaller, more focused datasets that are tailored to the needs of the task at hand.

Cloud models, on the other hand, provide stronger general reasoning capabilities and can handle multimodal inputs with ease. They are trained on vast amounts of data from a wide range of sources, allowing them to identify patterns and relationships that might be difficult to discern in smaller datasets. This makes them particularly well-suited for tasks that involve complex decision-making or the analysis of diverse data types.

The tiered inference pattern offers a practical approach to designing architectures that can leverage the strengths of both local and cloud models. By dividing tasks into distinct tiers, developers can allocate specific jobs to either local or cloud models, depending on the requirements of the application. This allows for the efficient use of resources and the creation of systems that can adapt to changing needs.

Leveraging the Power of Local AI Models

With the rise of local AI models, developers are gaining more control over their applications. Tools like Ollama are making local inference increasingly accessible, allowing engineers to fine-tune their models with greater precision.

This newfound control empowers developers with the flexibility to tailor their AI models to specific needs. By adjusting inference parameters and system prompts, engineers can optimize their models for better performance and accuracy.

The benefits of local AI models extend beyond just improved accuracy. With local models, developers can also enjoy greater autonomy and flexibility. They can experiment with different approaches without having to rely on cloud-based services, giving them the freedom to innovate and push the boundaries of what’s possible.

As local AI models become more prevalent, we can expect to see a shift in how developers approach AI application development. With the ability to control and customize their models, developers will be able to create more sophisticated and engaging applications that meet the unique needs of their users.

By leveraging the power of local AI models, developers can create more robust, efficient, and effective applications. This increased control and flexibility will enable them to push the boundaries of what’s possible with AI and create innovative solutions that transform industries and improve lives.

Harness engineering is a rapidly evolving discipline that focuses on creating AI agents that can design their environment and tools. This emerging field is transforming the way we approach software development, with significant implications for various industries.

At its core, harness engineering involves the development of AI agents that can modify and adapt their surroundings to optimize their performance and efficiency. This requires a deep understanding of the system’s dynamics and how different components interact with each other.

The surrounding system plays a crucial role in engineering outcomes, as AI agents rely on their environment to operate effectively. This interdependence highlights the importance of designing AI systems that are not only intelligent but also adaptable and resilient.

What is harness engineering, and how does it differ from traditional software development? Harness engineering emphasizes the need for a more holistic approach, where AI agents and their environment are designed together. This integrated approach enables the creation of more sophisticated and autonomous systems that can evolve over time.

Harness engineering is a promising field that holds great potential for innovation and growth. As it continues to mature, we can expect to see new breakthroughs in various areas, from AI development to software engineering.

Why Harness Engineering Matters

Harness engineering is a crucial aspect of agent-first development. Designing environments and feedback loops is essential for reliable performance. However, simply improving prompts is not enough to guarantee consistent results.

Effective agent-first development requires a deeper understanding of how to create environments that work in tandem with the agent’s code. This involves designing systems that can adapt to the agent’s actions and provide meaningful feedback. By doing so, developers can create agents that learn and improve over time, rather than just generating random or incorrect responses.

Building reliable agents is a complex task that requires careful consideration of the entire system. A single line of agent-generated code can have a significant impact on the overall performance of the agent, which is why having a robust harness is essential. With millions of lines of code involved, even small errors can have far-reaching consequences.

A reliable harness is not just a necessary tool, but an integral part of the development process. By focusing on harness engineering, developers can create agents that are more accurate, efficient, and effective.

Context Engineering for AI Agents

Repository documentation serves as an engineered input, a blueprint for the successful operation of an AI agent. Architecture rules, conventions, tests, and persistent agent state all play crucial roles in determining effectiveness.

When it comes to an AI agent’s performance, the quality of the context it can retrieve and maintain is a significant factor. An agent that can effectively retrieve relevant information and adapt to its environment is far more likely to achieve its goals than one that struggles with context.

Repository documentation provides a critical foundation for context engineering, establishing the framework for how an agent will interact with its environment. Architecture rules, for instance, dictate how the agent will structure its knowledge base, while conventions ensure that the agent can communicate effectively with other systems.

Tests and persistent agent state are also crucial components of context engineering, as they enable the agent to learn from its experiences and adapt to changing circumstances. By considering these factors, developers can create AI agents that are more effective, more reliable, and more capable of achieving their goals.

Long-Running Agents and Harnesses

The modern harness is a crucial component of harness engineering, which involves structured progress artifacts and incremental tasks. This allows for a more organized and efficient approach to continuous work. Harnesses are designed to adapt to new context windows, making it easier to pick up where you left off, even in different environments.

Initialization steps are essential for continued work in new context windows. They provide a clear starting point and ensure that ongoing tasks are properly set up. This is particularly important in harness engineering, where the goal is to create a seamless experience for users. By focusing on initialization, you can ensure that your harness is set up to handle new context windows with ease.

One of the key benefits of harness engineering is that it does not rely on previous model memory. This means that each new task or context window can be approached independently, without the need to reference prior work. This allows for greater flexibility and adaptability, making harness engineering an attractive solution for complex projects.

Harness engineering is the backbone of what is harness engineering, and understanding its principles is crucial for creating effective harnesses. By breaking down the process into smaller, incremental tasks, you can build a harness that is robust, efficient, and easy to use.

Verification and Feedback Loops for AI Agents

Tests, linters, type checking, and runtime checks are all crucial components for ensuring the reliability of AI agents. These tools help developers identify potential issues before they become major problems, but their limitations become apparent when the agent is deployed in the real world. Model-based confidence, which relies on the agent’s internal state to gauge its own performance, is no substitute for the kind of actionable feedback that can only come from executing code in a real environment.

To truly reliable and trustworthy, AI agents need to be able to detect and correct their own failures. This is where executable feedback loops come in – a process that involves running the agent’s code in a controlled environment and gathering feedback on its performance. By replacing model-based confidence with executable feedback loops, developers can gain a deeper understanding of their agent’s strengths and weaknesses, and make targeted improvements to its performance.

Executable feedback loops also enable agents to learn from their mistakes, adapting to new situations and improving their overall reliability over time. This means that AI agents can become increasingly capable and trustworthy, even in complex and dynamic environments. As developers, our job is to create the conditions for this process to occur, by building in the tools and mechanisms that allow the agent to learn from its mistakes and improve its performance.

Harness Engineering for the Enterprise

Enterprise harnesses are harnessing the power of governance to bridge the gap between identity, permissions, policies, and observability. They’re becoming the go-to solution for organizations seeking a unified approach to managing their infrastructure.

By combining identity, permissions, policies, and observability, enterprise harnesses provide a comprehensive governance layer that helps organizations stay in control. But that’s not all – audit trails and model/tool abstraction are also crucial components that enable organizations to track changes and streamline their workflows.

The beauty of enterprise harnesses lies in their ability to abstract away complex infrastructure, making it easier for organizations to manage their resources. This abstraction also enables more efficient model development, deployment, and monitoring. With enterprise harnesses, organizations can focus on building and deploying applications, rather than getting bogged down in the intricacies of infrastructure management.

The Key Design Question

The key design question for backend engineers is no longer about crafting the perfect prompts. Gone are the days of tweaking every detail to coax the desired response from AI agents. Instead, the focus has shifted to designing the environment, capabilities, and feedback system that enables these agents to perform at their best.

This comprehensive approach to design requires considering the intricacies of how AI agents interact with their surroundings. It involves creating a harmonious balance between the agent’s abilities, the data it receives, and the consequences of its actions. This delicate balance is crucial for building reliable AI agents that can adapt to new situations and learn from their mistakes.

Reliability in AI agents is not a binary concept. It’s not a matter of simply choosing the right tools or techniques. Rather, it’s a multifaceted challenge that demands a thoughtful and systematic approach. By designing the right environment, capabilities, and feedback system, engineers can create AI agents that are resilient, consistent, and able to perform their intended tasks with accuracy.

The stakes are high, and the consequences of failure can be severe. Whether it’s a chatbot that provides incorrect information or a recommendation engine that makes ill-advised suggestions, the impact of unreliable AI agents can be far-reaching. As such, backend engineers must prioritize design and focus on creating a robust and reliable foundation for their AI agents.
